RL for LLMs & reasoning

Preference-based RL, RLHF, direct alignment and verifiable-reward reasoning RL. Christiano, InstructGPT, DPO, GRPO and RLVR are core; the rest is a specialisation, not a prerequisite for other tracks. The language-model half — tokenised sequences, pretraining, supervised fine-tuning — is assumed here rather than taught, so bring it with you.

What you will learn

Phase 3 gave you PPO with a reward you could write down. A language model's reward is a human preference or the correctness of an answer, and the policy is a model with billions of parameters held near a pretrained reference by a KL penalty.

Preference-based RL from Christiano through the InstructGPT recipe, direct alignment (DPO and its variants), then reasoning RL: GRPO's critic-free group baseline, verifiable rewards, the R1 and o1 results, the fixes in DAPO and Dr. GRPO, sequence-level and value-based alternatives, process rewards and agentic RL. Two exercises: train a reward model against DPO, and run GRPO with a rule-based reward.

You can explain the three RLHF stages and what DPO removes, implement GRPO on a small model, and read a reasoning-RL paper knowing which of its choices carry the result.

Training language models to follow instructions with human feedback

The three-stage recipe: supervised fine-tuning on demonstrations (SFT), a reward model fit to human preferences, then PPO against that reward with a KL penalty back to the SFT policy. Non-negotiable.

The template behind ChatGPT and all subsequent LLM RL.

Learning outcome: Draw the three-stage pipeline and say what data each stage needs.

Direct Preference Optimization

Reparameterise the RLHF objective so the LM is its own reward model. A simple supervised loss, no RL loop. Non-negotiable.

Spawned the direct-alignment family.

Learning outcome: Explain how DPO removes the reward model and the RL loop, and what it gives up.

Deliverable: two runs, one comparison

Preferences into a policy, twice

Train a small reward model on a preference dataset and report its held-out accuracy, then run DPO on the same preferences and compare both against the SFT baseline under one evaluation.

The two halves of alignment practice, on a scale you can iterate on.

Learning outcome: Say what preference data does and does not encode, having fit it two different ways.

Resources

Exercise deliverables

  • A small reward model with held-out pairwise accuracy reported
  • DPO run on the same preference data with a small instruct model
  • Both compared against the SFT baseline under one stated evaluation
  • A paragraph on what the preference data failed to encode

DeepSeekMath (introduces GRPO)

Drop PPO's critic. Sample a group of responses per prompt and use group-relative rewards as the baseline. Non-negotiable.

The algorithm behind DeepSeek-R1 and the default for reasoning RL.

Learning outcome: Write GRPO's advantage and say exactly what it replaces in PPO.
